Introduction to LLM Training

Large Language Models (LLMs) are artificial intelligence systems designed to process and understand human language. Researchers have been testing these models to see how well they can generalize and apply what they’ve learned to new, unseen tasks. A recent study focused on the limitations of LLMs when faced with tasks that differ from their training data in terms of type, format, and length.

Methodology of the Study

The researchers used simplified models and tested them with a variety of tasks. Some tasks closely matched the patterns in the training data, while others required the model to perform novel transformations that were not directly demonstrated during training. For example, a model trained on data showing two cyclical shifts might be asked to perform a transformation involving two ROT shifts, even if it had only seen a single example of either shift. The accuracy of the models’ responses was measured using BLEU scores and Levenshtein Distance.

Findings of the Study

As hypothesized, the basic models started to fail when asked to generalize novel sets of transformations that were not directly demonstrated in the training data. While the models would try to generalize new logical rules based on similar patterns in the training data, this often led to "correct reasoning paths, yet incorrect answers." In other cases, the LLM would sometimes stumble onto correct answers paired with "unfaithful reasoning paths" that didn’t follow logically. The researchers concluded that the models’ ability to reason under task transformations appears to reflect a replication of patterns learned during training, rather than a true understanding of text.

Limitations of LLMs

The researchers also tested their controlled system using input text strings that were slightly shorter or longer than those found in the training data, or that required function chains of different lengths. In both cases, the accuracy of the results deteriorated as the discrepancy increased, indicating the failure of generalization in the models. Small, unfamiliar discrepancies in the format of the test tasks also caused performance to degrade sharply and affected the correctness of the model’s responses.

Visualizing the Results

The study’s findings are illustrated in graphs, which show how the models’ performance changes as the tasks get further outside the training distribution. The graphs indicate that as the requested tasks deviate from the training data, the answers provided drift farther from the desired answer.
